DuoAttention: How Splitting Retrieval and Streaming Heads Slashes KV Memory for 3.3M Tokens
MIT HAN Lab shows that a large fraction of transformer attention heads (e.g., 50% to 75% depending on architecture) can be treated as streaming heads, enabling 3.3M context lengths on a single GPU without losing needle retrieval.
Long-context inference has hit a hard memory wall: running a 1-million-token prompt on Llama-3-8B in FP16 consumes more than 137 GB of memory solely for the Key-Value (KV) cache, instantly blowing past the 80 GB limit of high-end enterprise GPUs. While existing compression techniques either evict critical historical tokens dynamically or settle for heavy loss in long-range recall, researchers from MIT HAN Lab, Tsinghua University, and NVIDIA have exposed a fundamental structural truth about autoregressive transformers: attention heads are not uniform, and the vast majority of them never perform global retrieval.
Their framework, DuoAttention, separates attention heads into two distinct functional categories—Retrieval Heads and Streaming Heads. By applying a full KV cache strictly to the minority of heads that actually perform global context synthesis, while pinning the rest to a tiny, constant-length sliding window, DuoAttention reduces KV cache memory consumption by up to 2.55× for Multi-Head Attention (MHA) and 1.67× for Grouped-Query Attention (GQA). Paired with 4-bit KV quantization, the system decodes sequences of 3.3 million tokens on a single A100 GPU with virtually zero degradation on standard long-context benchmarks.
The Fallacy of Uniform KV Allocation
Standard inference engines treat every attention head identically. In a modern architecture like Llama-3 or Mistral, every head in every layer allocates memory linearly as context grows, storing every key and value vector from token 1 to token N:
- Linear Space Explosion: At 128K context, the KV cache dwarfs model weights; at 1M tokens, serving becomes prohibitively expensive or requires tensor parallelism across multiple 8-GPU nodes simply to hold activations.
- Eviction Overhead: Dynamic token-pruning methods (such as H2O, SnapKV, or Quest) attempt to drop tokens at runtime, but calculating attention heatmaps, maintaining eviction queues, and reloading evicted states introduces substantial GPU kernel latency and thrashing.
- Loss of Needles: Uniform sliding-window techniques (like StreamingLLM) drop middle-context tokens indiscriminately, resulting in catastrophic failure whenever a query requires factual recall across distant passages.
By profiling attention weight distributions across layers and sequence lengths, the authors observed an extreme functional bifurcation: only a fraction of attention heads (such as 25% for MHA and 50% for GQA models) require full context retention. The remaining heads exhibit purely localized patterns, attending almost exclusively to initial attention sinks (the first 4–16 tokens) and the immediate local window (the most recent 256–512 tokens).
Allocating full KV memory across all heads is therefore massively redundant.

DuoAttention restructures attention computation into a static, two-track serving pattern:
- Retrieval Heads (Global Cache): These heads retain the complete historical KV cache from sequence start to current position
N. They preserve the model's capacity for cross-document summarization, multi-hop logic, and needle-in-a-haystack extraction. - Streaming Heads (Constant-Length Cache): These heads retain only fixed attention sinks (e.g., first 64 tokens) and a rolling sliding window (e.g., last 512 tokens). Once an intermediate token falls outside the active sliding window, its key and value tensors are immediately dropped from memory without dynamic recalculation.
Because the head assignment is static and determined prior to serving, DuoAttention eliminates all dynamic token bookkeeping during decoding. FlashAttention and FlashInfer kernels can execute directly over the pre-partitioned heads without synchronization barriers or CPU-GPU round trips.
Automated Identification via Continuous Gating
Hand-crafting which heads belong to which category across 32 or 80 transformer layers is infeasible and model-specific. DuoAttention automates this via a lightweight, training-free optimization objective.
The researchers assign a continuous gating parameter α between 0 (streaming attention) and 1 (full attention) to each attention head i. The optimization objective minimizes the Kullback-Leibler (KL) divergence and output error between the masked model and the full-attention reference over a compact set of synthetic passkey and retrieval prompts:
- Objective Function:
min_α Loss(M_α, M_full) + λ · ||α||₁ - L1 Regularization: A penalty term
λ · ||α||₁drives as many head gates as possible toward 0, forcing non-essential heads into streaming mode while safeguarding the minimal set of heads required to preserve exact output distributions. - Execution Speed: The optimization requires zero parameter fine-tuning and processes only a few dozen synthetic samples.
Once optimized, the continuous gates are thresholded into binary masks (0 for streaming, 1 for retrieval), producing fixed configuration patterns for models such as Llama-3-8B, Llama-3.1-8B, and Mistral-7B.
Benchmark Performance and Throughput Gains
The empirical results show that DuoAttention delivers major hardware efficiencies while matching uncompressed baseline accuracy across standard long-context benchmarks.
1. Memory and Latency Improvements
- Memory Reduction: Slashes KV cache memory by 2.55× for Multi-Head Attention (MHA) and 1.67× for Grouped-Query Attention (GQA).
- Decoding Speedup: Accelerates autoregressive decoding throughput by up to 2.18× on MHA models and 1.50× on GQA models.
- Pre-filling Latency: Reduces prompt pre-filling time by 1.73× and 1.63× for MHA and GQA, respectively, by eliminating quadratic attention computations across streaming heads.
2. Long-Context Accuracy Retention
- Needle In A Haystack (NIAH): Achieves comparable accuracy to full attention on Needle-in-a-Haystack benchmarks across sequence lengths from 32K up to 1M tokens on
Llama-3-8B-Instruct-1048K, matching full-attention baselines and outperforming token-eviction baselines like FastGen and StreamingLLM. - LongBench: On long-context benchmarks like LongBench, DuoAttention maintains minimal accuracy loss compared to full attention, outperforming heuristic sparsity approaches that degrade significantly on complex multi-span queries.
3. The 3.3 Million Token Frontier
By combining DuoAttention's selective head caching with standard 4-bit per-channel KV quantization (Int4), the authors pushed context serving limits to unprecedented heights: a single 80 GB NVIDIA A100 executed decoding across 3.3 million tokens of active context without distributed model parallelism.
Architectural Implications for Inference Infrastructure
DuoAttention demonstrates that long-context scaling bottlenecks do not stem from intrinsic architectural flaws in self-attention, but from allocation symmetry.
By acknowledging that individual attention heads specialize into distinct routing versus local syntactic roles, runtime systems can decouple KV memory scaling from sequence length for over 75% of model capacity. As open-source inference frameworks (including vLLM, TensorRT-LLM, and SGLang) integrate head-aware memory engines, DuoAttention establishes a practical blueprint for serving million-token workloads at fraction-of-the-cost unit economics.
